Sparse kernel learning with LASSO and Bayesian inference algorithm

چکیده
Kernelized LASSO (Least Absolute Selection and Shrinkage Operator) has been investigated in two separate recent papers [Gao, J., Antolovich, M., & Kwan, P. H. (2008). L1 LASSO and its Bayesian inference. In W. Wobcke, & M. Zhang (Eds.), Lecture notes in computer science: Vol. 5360 (pp. 318-324); Wang, G., Yeung, D. Y., & Lochovsky, F. (2007). The kernel path in kernelized LASSO. In International conference on artificial intelligence and statistics (pp. 580-587). San Juan, Puerto Rico: MIT Press]. This paper is concerned with learning kernels under the LASSO formulation via adopting a generative Bayesian learning and inference approach. A new robust learning algorithm is proposed which produces a sparse kernel model with the capability of learning regularized parameters and kernel hyperparameters. A comparison with state-of-the-art methods for constructing sparse regression models such as the relevance vector machine (RVM) and the local regularization assisted orthogonal least squares regression (LROLS) is given. The new algorithm is also demonstrated to possess considerable computational advantages.

Priors on the Variance in Sparse Bayesian Learning; the demi-Bayesian Lasso
We explore the use of proper priors for variance parameters of certain sparse Bayesian regression models. This leads to a connection between sparse Bayesian learning (SBL) models (Tipping, 2001) and the recently proposed Bayesian Lasso (Park and Casella, 2008). We outline simple modifications of existing algorithms to solve this new variant which essentially uses type-II maximum likelihood to f...
متن کاملPAC-Bayesian Bound for Gaussian Process Regression and Multiple Kernel Additive Model
We develop a PAC-Bayesian bound for the convergence rate of a Bayesian variant of Multiple Kernel Learning (MKL) that is an estimation method for the sparse additive model. Standard analyses for MKL require a strong condition on the design analogous to the restricted eigenvalue condition for the analysis of Lasso and Dantzig selector. In this paper, we apply PAC-Bayesian technique to show that ...
متن کاملSpike and Slab Variational Inference for Multi-Task and Multiple Kernel Learning
We introduce a variational Bayesian inference algorithm which can be widely applied to sparse linear models. The algorithm is based on the spike and slab prior which, from a Bayesian perspective, is the golden standard for sparse inference. We apply the method to a general multi-task and multiple kernel learning model in which a common set of Gaussian process functions is linearly combined with...
متن کاملGeneralized spike-and-slab priors for Bayesian group feature selection using expectation propagation
We describe a Bayesian method for group feature selection in linear regression problems. The method is based on a generalized version of the standard spike-and-slab prior distribution which is often used for individual feature selection. Exact Bayesian inference under the prior considered is infeasible for typical regression problems. However, approximate inference can be carried out efficientl...
متن کاملA* Lasso for Learning a Sparse Bayesian Network Structure for Continuous Variables
We address the problem of learning a sparse Bayesian network structure for continuous variables in a high-dimensional space. The constraint that the estimated Bayesian network structure must be a directed acyclic graph (DAG) makes the problem challenging because of the huge search space of network structures. Most previous methods were based on a two-stage approach that prunes the search space ...
